Key takeaways

  • Quantization error is the difference between an original value and its rounded, quantized version.
  • For a uniform quantizer with step size delta, the maximum error is delta over two; each extra bit adds about 6 dB of signal quality.
  • Quantization lowers precision, pruning removes weights, and distillation trains a smaller student model.
  • For speed, quantize first, then consider distillation; prune when hardware benefits from sparsity.
  • 'Unknown quantization type' errors usually mean your Transformers version does not support the model's quantization format.

Quantization error is the difference between an original value and the value it becomes after quantization, rounding to a limited set of levels. It appears in audio and image digitisation and in AI models stored in fewer bits. In FineTune Studio, I use 4-bit QLoRA, where managing quantization error is part of keeping quality high. This page covers calculating and reducing quantization error, how quantization compares with pruning, distillation, encoding and discretization, Ableton's global quantization, and a common Hugging Face error.

What is quantization error?

Quantization error is the gap between a continuous or high-precision value and its quantized approximation. If a signal value of 3.7 is rounded to level 4, the error is 0.3. Across a signal, these errors behave like added noise, called quantization noise.

In audio, quantization error determines the noise floor of a recording; more bits mean smaller errors. In images, too few levels cause visible banding. In neural networks, quantizing weights from 16-bit floats to 4-bit integers introduces small errors in every weight, which can slightly change outputs. Good quantization methods arrange levels and scaling so the errors that matter most stay small.

How do I calculate quantization error?

For each value, error equals the quantized value minus the original value. For a uniform quantizer with step size delta, rounding error lies between minus delta over two and plus delta over two, so the maximum error is delta over two.

Assuming errors are spread evenly, the mean squared error is delta squared divided by 12. Step size is the range divided by the number of levels: an 8-bit quantizer over a range of 0 to 1 has 256 levels, so delta is about 0.0039. In signal processing, the signal-to-quantization-noise ratio for a full-scale sine wave is about 6.02 times the number of bits plus 1.76 decibels, so each extra bit adds about 6 dB.

How can quantization error be reduced?

Use more bits, match the quantizer's range to the actual data, use non-uniform levels where values cluster, add dither in audio to make errors less structured, and in neural networks use calibration, per-group scaling and error-aware methods.

For AI models specifically:

  • Quantize in small groups of weights, each with its own scale.
  • Use calibration data to protect important weights, as AWQ and GPTQ do.
  • Keep sensitive layers, such as embeddings or outputs, in higher precision.
  • Use formats suited to weight distributions, such as NF4.
  • Fine-tune after quantization, or use quantization-aware training.

Always measure task accuracy, not just numeric error.

What is the difference between quantization and pruning?

Quantization keeps all weights but stores them with fewer bits. Pruning removes weights, or whole neurons, heads or layers, that contribute little, making the network sparse or smaller. Both compress models, and they can be combined.

Quantization gives reliable memory and speed gains on standard hardware and is easy to apply after training. Pruning's speed benefits depend on hardware: removing scattered individual weights rarely speeds up GPUs unless they support structured sparsity, while removing entire channels or layers gives real gains but needs more careful retraining. The classic Deep Compression work combined pruning, quantization and encoding to shrink networks dramatically.

What is the difference between quantization and distillation?

Quantization compresses an existing model by lowering numeric precision. Distillation trains a new, smaller student model to imitate a larger teacher model's outputs, transferring knowledge into fewer parameters.

Quantization is fast, needing minutes to hours and little data, and keeps the same architecture. Distillation takes a full training run with substantial data and compute, but can produce a much smaller, faster model. Many small language models are distilled from larger ones. You can also combine them: distil a small model, then quantize it for deployment on phones or browsers.

When should I use pruning, quantization or distillation to optimise speed?

Start with quantization because it is quick, widely supported and usually gives large gains with small quality loss. Use distillation when you need a much smaller model for a narrow task and can afford training. Use pruning when hardware benefits from structured sparsity or you can remove whole components.

Also consider non-compression optimisations: better serving engines with batching, caching, shorter prompts, smaller context, faster hardware and choosing a smaller base model. Measure speed and quality on your real workload after each change. In many applications, a quantized small model with good retrieval outperforms an unoptimised large model on both cost and latency.

What is the difference between quantization and encoding?

Quantization maps values to a limited set of levels, losing information. Encoding represents those levels as bits or symbols for storage or transmission, and can be lossless. In digital audio, quantization picks the level; encoding writes it as a binary number.

Compression systems use both: quantization reduces precision, then entropy coding such as Huffman coding stores the result efficiently. In JPEG images, transformed coefficients are quantized, the lossy step, then encoded losslessly. In machine learning, quantized weights are encoded in formats such as GGUF, which pack low-bit values and their scales efficiently.

What is the difference between quantization and discretization?

Discretization is the general process of converting continuous things into discrete ones, which includes sampling in time or space and quantization of values. Quantization specifically refers to discretizing the amplitude or value range into levels.

In data science, discretization also means binning continuous features into categories, such as turning ages into ranges. In numerical methods, it means approximating continuous equations on a grid. So all quantization is discretization, but not all discretization is quantization. The terms overlap in casual use, especially in machine learning, where "quantization" usually refers to precision reduction of model weights.

Where is global quantization in Ableton?

In Ableton Live, the global quantization chooser is in the Control Bar at the top of the window, near the tempo and metronome controls. It sets when clips launch in Session View, such as on the next bar, beat or fraction of a beat.

Clips can override it with their own launch quantization in the clip's settings. Global quantization keeps live performance in time by delaying clip launches to the chosen boundary. This is different from MIDI note quantization, which moves recorded notes to the grid, found in the Edit menu or with the quantize shortcut. Music quantization shares the core idea of snapping values to a grid.

Why does Hugging Face DeepSeek code give an "unknown quantization type" error?

Usually because the model's configuration specifies a quantization format, such as FP8 weights in some DeepSeek releases, that your installed Transformers version does not recognise. Older library versions cannot parse newer quantization configs.

Also asked as: why does huggingface-provided deepseek code result in an 'unknown quantization type' error

Fixes:

  • Upgrade Transformers and related libraries to recent versions.
  • Use a serving engine designed for the model, such as vLLM or SGLang.
  • Use a converted version in BF16 or another supported format.
  • Use a smaller distilled model if your hardware cannot run the original.

Check the model card for recommended loading code and hardware, since very large models need multiple high-memory GPUs regardless of quantization.
